Common Challenges in AI Software Development (and How to Fix Them)

A team trains a model. It scores 94% accuracy on the test set and everyone celebrates. Two weeks after launch, the sales team stops trusting it because it keeps flagging loyal customers as likely to leave. No error shows up in the logs. No service crashes. The model simply met real data and behaved differently.

This is a made-up scenario, but most developers who ship machine learning have lived a version of it. It shows the core of the challenges in AI software development: your code can be perfect while the system still fails, because its behavior comes from data and not only from the rules you wrote.

A 2024 RAND Corporation report, The Root Causes of Failure for Artificial Intelligence Projects and How They Can Succeed, interviewed 65 experienced data scientists and engineers. It notes that by some estimates more than 80% of AI projects fail, twice the rate of IT projects without AI. That is an estimate, not a measured count, so read it as a warning.

Gartner predicted in February 2025 that organizations will abandon 60% of AI projects that lack AI-ready data through 2026.

This guide is for developers who build or maintain AI features. You will learn why AI projects fail, which problems appear at each stage, and how to overcome AI development challenges with code you can adapt today.

What Are the Common Challenges in AI Software Development?

Why Do AI Projects Fail Before Reaching Production?

RAND's interviews point to five root causes. Leaders misunderstand the problem the AI should solve. The organization lacks the data to train a useful model. Teams chase new technology instead of solving a real user problem. The infrastructure for data and deployment is too weak. And sometimes the problem is too hard for current AI.

Only the last cause is about the model itself. The other four are about people, data and plumbing.

The developer fix: write a one-paragraph problem statement before you touch code. Name the user, the decision the model supports, the metric that matters, and the cost of a wrong answer.

Here is a hypothetical example. A support team asks for "an AI to reduce tickets." A better version: Sort incoming tickets into four categories so urgent billing issues reach a human within 15 minutes. Success means catching at least 95% of urgent tickets on a hand-labeled sample. Wrongly marking a ticket "not urgent" is worse than wrongly marking it "urgent." Now you know the metric to optimize (recall on urgent tickets) and what to test.

How Do Data Quality Issues in AI Break Your Model?

Bad data causes the most confusing failures because training runs without complaint. Gartner's analyst put it bluntly: if the data has issues, it is not ready for AI.

The usual suspects are missing values, duplicate rows, unbalanced labels, wrong labels and stale records. Data quality problems in machine learning projects also hide in leakage. If the same customer appears in both training and test sets, your accuracy looks great and means nothing. Split by customer, not by row.

Run this on every training run, not once:

import pandas as pd

def check_training_data(df: pd.DataFrame, label_col: str = "label") -> list[str]:
    """Return a list of data problems. An empty list means the checks passed."""
    problems = []

    missing_share = df.isna().mean()
    for column, share in missing_share[missing_share > 0.05].items():
        problems.append(f"{column}: {share:.0%} missing values")

    duplicate_share = df.duplicated().mean()
    if duplicate_share > 0.01:
        problems.append(f"{duplicate_share:.1%} duplicate rows")

    label_share = df[label_col].value_counts(normalize=True)
    if label_share.min() < 0.05:
        problems.append(f"label '{label_share.idxmin()}' is only {label_share.min():.1%} of rows")

    return problems

Call it in CI and fail the build when the list is not empty.

Limitation: These checks catch format problems, not truth. A column can be complete, unique and balanced, and still wrong. Sample rows and read them by hand.

Why Is Testing AI Software So Hard?

A model has no spec to assert against. "Correct" is statistical. A systematic literature review of software engineering for AI and ML (arXiv:2011.03751) found software testing and AI software quality at the top of the challenge categories it analyzed.

A practical setup uses three layers: normal unit tests for the code around the model, an evaluation set the model never trains on (reported by slice, such as region or language, so a good average cannot hide a broken segment), and output contracts for LLM features.

LLM answers vary between calls, so validate structure instead of comparing strings. This example uses Pydantic v2 and retries when the output breaks the contract:

from pydantic import BaseModel, Field, ValidationError

class TicketSummary(BaseModel):
    category: str = Field(pattern="^(billing|bug|account|other)$")
    urgent: bool
    summary: str = Field(max_length=300)

def get_ticket_summary(ticket_text: str, max_retries: int = 2) -> TicketSummary:
    prompt = f"Return JSON with category, urgent and summary for this ticket:\n{ticket_text}"

    for _ in range(max_retries + 1):
        raw_output = ask_model(prompt) # your own wrapper around any LLM API
        try:
            return TicketSummary.model_validate_json(raw_output)
        except ValidationError as error:
            reason = error.errors()[0]["msg"]
            prompt += f"\nYour last answer was invalid ({reason}). Return valid JSON only."

    raise RuntimeError("Model did not return valid output after retries")

This guards the shape of the answer, not its correctness. Pair it with an evaluation set of real, hand-labeled tickets.

What Are the Biggest AI Model Deployment Challenges?

AI model deployment challenges usually start where the notebook ends.

Training-serving skew. You compute a feature one way in the notebook and another way in the API. Share one feature function between both paths and log the features the model actually received.

Latency and cost. Two seconds per request is fine for a nightly batch job and painful on a checkout page. LLM calls also add per-token cost. Measure p95 latency and cost per request before launch.

Versioning and rollback. Version the model, the data snapshot and the prompt together. Release to a small share of traffic first, such as 5%, and keep the old model one config flag away.

Error handling. Models time out and APIs hit rate limits. Decide the fallback in advance: a rule-based answer, a cached result or a clear error.

How Does Model Drift Hurt Accuracy After Launch?

The Google paper Hidden Technical Debt in Machine Learning Systems (Sculley et al., NeurIPS 2015) lists changes in the external world and hidden feedback loops among the ML-specific risks. Drift means live data stops looking like training data.

A simple check compares a feature's training values with last week's live values:

from scipy.stats import ks_2samp

def feature_has_drifted(train_values, live_values, p_threshold=0.01, gap_threshold=0.1):
    result = ks_2samp(train_values, live_values)
    # statistic = size of the gap between the two distributions (0 to 1)
    drifted = result.pvalue < p_threshold and result.statistic > gap_threshold
    return drifted, result.statistic

With large samples, the p-value shrinks even for harmless differences, so the code also checks the gap size. Tune both thresholds on your own history. When an alert fires, investigate before you retrain. A broken upstream pipeline is a common cause.

How Do You Keep AI Applications Secure?

The OWASP GenAI Security Project maintains the Top 10 for LLM Applications. The 2025 edition kept prompt injection at number one, and a 2026 edition followed in August 2026. Prompt injection means input that pushes the model to ignore your instructions. It can hide in a web page or document your app reads, not only in the chat box.

• Treat model output as untrusted input. Validate and escape it before it reaches SQL, a shell or HTML.
• Give the model's tools the least access they need.
• Keep secrets out of prompts, because developers cannot assume prompt text stays private.
• Log every tool call so you can audit what the model did.

Why Does AI Technical Debt Grow So Fast?

Sculley and his coauthors argue that building an ML system is fast and cheap, while maintaining it is slow and expensive. Watch for entanglement (changing one input shifts the whole model), undeclared consumers (another team quietly uses your predictions) and data dependencies Nobody owns it.

Keep a short model card in the repo with inputs, metrics, known limits and every system that consumes the output. Reserve maintenance time at planning, not after launch.

How to Overcome AI Development Challenges: A Checklist

Always train a dumb baseline first, such as the most common class or a simple rule. If a complex model barely beats it, you may be chasing technology instead of solving the problem, the trap RAND describes.

Conclusion

Most challenges in AI software development are not model problems. They come from unclear goals, weak data, thin testing and missing monitoring. Fix those in order and the model becomes the easy part.

Pick one item and ship it this week: add the data checks to CI, or write the problem statement for your current project.
