LangGraph vs CrewAI vs AutoGen: 107 Real Data Engineering Tasks at Scale

Benchmarks Expose Framework Weaknesses

Framework docs push toy problems and happy-path APIs. Scale to 100+ tasks and those abstractions start leaking. Docs gloss over the chaos of orchestrating stateful LLM agents and the error handling thicket that follows. “Easy orchestration” or “robust error recovery” are hollow promises if your flow deadlocks on task 22 or your LLM bill jumps $48 overnight. Large, heterogeneous benchmarks show which frameworks survive—and which waste your time.

107 Real Data Engineering Tasks: The Testbed

This benchmark suite uses 107 production-flavored data engineering tasks: extraction (APIs, PDFs, HTML), transformation (schema normalization, deduplication, feature creation), load (Snowflake, S3, Postgres), QA (null checking, anomaly flagging), and small DAGs. Every task is I/O-bound and LLM-assisted, meeting these specs:

• At least one API/DB call per task
• Text or semi-structured payloads (median: 100KB)
• OpenAPI or direct SQL/NoSQL interface
• 1-6 LLM calls per task (GPT-4-turbo or Claude 3 Opus)
• Hard SLO: <15s median runtime; target cost $0.01/task

25%+ of tasks involve agent chaining, error recovery, or fuzzy duplicate detection. This set reflects hardened ELT/LLMops, with agent design complexity well beyond toy demos.

LangGraph: Directness, Boilerplate, and Scale Friction

LangGraph markets “fine-grained, composable multi-agent orchestration” built on LangChain. It’s Python-only, deterministic, and makes DAG, step control, and state explicit.

This explicitness = boilerplate. Here’s a runnable minimal ETL example:

Scale Realities:

• Error recovery is manual: By task 20, every node needs explicit try/catch, retries, and output validation.
• Duplication sets in fast: One DAG per task family; repeated node code is inevitable. Metaprogramming helps, at the cost of debuggability.
• Cross-DAG hacks: Upstream/downstream coordination often needs awkward global state or out-of-band callbacks.
• State is always transparent: Debugging is clear. You always know where and why it failed.

LangGraph offers predictable control and speed, but you pay in code volume as complexity climbs.

CrewAI Abstraction Fails Past 10-Tasks

CrewAI promises “modular agent collaboration, minus orchestration pain.” On first use, it delivers—until you orchestrate beyond about 10 agents or tasks. CrewAI ETL sample:

Scale Gripes:

• Task abstraction leaks: Mapping variable dependencies gets ugly. Chaining outputs from N to M tasks becomes brittle.
• State flows break down: Chaining three or more hops causes intermittent “variable not found” errors. Debugging is slow.
• Agent/job sprawl: Scaling out means hundreds of classes and jobs, losing modularity fast.
• Retry handling is obscure: You get less boilerplate than LangGraph, but less control or clarity when things go wrong.

CrewAI is ergonomic up to the composability cliff. You’ll rewrite flows or break abstractions once you hit it.

AutoGen: Smooth Onboarding, Steep Cost/Latency Penalty

AutoGen claims “automated agent orchestration” and automates message passing and memory out of the box. For linear or loosely coupled flows, it feels like cheating. The ETL, implemented with core agents:

Scaling Problems:

• Token/cost bloat: Lazy message pruning: prompt context balloons as flow depth grows. Token cost and memory overshoot LangGraph and CrewAI by 30-90% as chain length increases (source).
• Latency spikes: Agent and message graph depth cause quadratic latency increases.
• Opaque error chains: Failures in agent chains often propagate as generic exceptions, making forensics noisy.
• Automation ROI: Near-zero effort for simple tool invocations—best-in-class onboarding speed and smooth API calls, but only for surface-level flows.

AutoGen is seductive for demos, dangerous for production. Cost and latency scale out of control as real workflow depth grows.

107-Task Benchmark: Aggregate Runtime, Cost, and Errors

Below: aggregate results for all 107 tasks, on the same 8-core ARM node, with capped I/O to avoid rate limits. All LLM runs used GPT-4-turbo, with Postgres as the sink.

Takeaways:

• LangGraph consistently hits runtime SLOs, and traceability is best.
• CrewAI’s abstraction overhead inflates token use—mostly redundant prompt plumbing.
• AutoGen’s cost and latency compound rapidly; message churn drives up usage and bill.

How Each Framework Breaks in the Real World

The true limits emerge only at scale.

• LangGraph: Boilerplate is the tax. By DAG 30, scaffolding dwarfs business logic. Explicit state prevents silent errors, but code volume kills velocity.
• CrewAI: The composability wall arrives around 45 tasks. Real ELT/LLMops needs dataflows, not just agent chatrooms—API abstracts break down and rewrites become constant.
• AutoGen: Latency and cost runaway hit hardest. Flows with >3 agents or long message threads will see at least 30% bloat. Demos go smoothly, but retries multiply cost and SLO slips.

Pain nobody advertises:

• Deep CrewAI flows throw cryptic “Variable not found” errors, requiring painful step-by-step backtracking.
• LangGraph deadlocks happen when you forget a DAG edge. Debuggable, but always your responsibility.
• AutoGen silently resends full history to all agents, doubling costs—by design. Expect token surprise.

Long-run success is a product of running scale benchmarks, measuring costs, and understanding state and logs. Ergonomics don’t survive combinatorial complexity. Save skepticism for “seamless orchestration” claims. Only code and real bills matter.
